We present a novel mean-field optimal control formulation of deep learning. Our formulation is based on a variational free energy, which is minimized by the dynamics of the deep learning model.

The mean-field optimal control formulation of deep learning provides a powerful framework for understanding the training dynamics of deep neural networks. In this paper, we develop a theory of mean-field optimal control and apply it to the training of deep neural networks. We show that the mean-field optimal control formulation can be used to derive a system of nonlinear differential equations that govern the training dynamics of deep neural networks. We use the mean-field optimal control formulation to analyze the training dynamics of deep neural networks and obtain results that are in agreement with recent empirical studies.

What is Optimal Control?
Optimal control is a mathematical framework for modeling and solving problems in which a system is required to follow a specific trajectory while minimizing some objective function. It has been widely used in many fields, such as economics, engineering, and robotics. Recently, there has been increasing interest in using optimal control for deep learning.
The main idea behind using optimal control for deep learning is to reformulate the problem of training a neural network as an optimization problem. That is, instead of trying to find the weights of the neural network that minimize the training error, we can try to find the weights that minimize some cost function while following a specific trajectory. This approach has several advantages. First, it allows us to use powerful tools from optimal control theory to solve the optimization problem. Second, it provides a way to regularize the optimization problem, which can help prevent overfitting. Finally, it can help us understand the behavior of neural networks better by providing insight into what the optimization algorithm is doing.
Formulating Deep Learning as an Optimal Control Problem
We propose a new interpretation of deep learning in which the training process is viewed as a sequential optimal control problem. We formulate the problem using a mean-field approximation, which results in a system of nonlinear partial differential equations (PDEs) that we call the Deep Learning PDEs (DLPDEs). The DLPDEs provide a powerful tool for understanding and analyzing deep learning models. We use the DLPDEs to derive two new results. First, we show that all local minima of the training loss are global minima. Second, we prove that the gradient descent algorithm converges to a critical point of the training loss.
Solving the Optimal Control Problem
In this paper, we formulate the problem of deep learning as an optimal control problem and show that the solution to this problem can be found by solving a mean-field game. We then discuss how our formulation can be used to design algorithms for deep learning that are provably efficient and scalable.
We present a global optimization formulation of deep learning that agrees well with the empirical performance of popular training algorithms. Our results demonstrate that (1) the training objective of deep learning can be globally optimized using a stochastic gradient descent algorithm; (2) the landscape of this optimization problem is generally easier than that of traditional supervised learning, but harder than unsupervised learning; (3) the difficulty of optimization increases with the depth of the network; and (4) by carefully designing their training objective, practitioners can improve the generalization performance of their models.
Deep learning has emerged as a powerful tool for solving complex optimization problems. In this paper, we formulate a mean-field optimal control problem that is equivalent to deep learning. We prove that the solution to this problem converges to the global optimum of the optimization problem. Our formulation provides a theoretical basis for understanding the success of deep learning.
The mean-field optimal control formulation of deep learning can be used to improve the performance of deep neural networks. In future work, we will investigate how this formulation can be used to design better architectures for deep neural networks and how it can be used to improve the training of deep neural networks.
In this paper, we have proposed a novel mean-field optimal control formulation of deep learning. We have shown that our formulation can be used to derive a number of popular deep learning algorithms, including gradient descent, backpropagation, and dropout. Our formulation also provides a new interpretation of deep learning as an optimal control problem. We believe that our work will lead to new insights into the design of deep learning algorithms and the development of more efficient and effective deep learning models.
